Requirements:

High-level workflow:

1. Instrumentation & metric catalog

   • Define canonical metrics per model: accuracy/auc, calibration, precision/recall per segment, inference latency, throughput, input feature distributions, label/target distribution.
   • Store metric definitions, owners, thresholds in a metrics registry (metadata + versioning).

2. Ownership (who owns what)

   • Data Scientist (Model Owner): owns model performance metrics, thresholds, alert definitions, and investigation of performance/regression causes.
   • Data Engineer: owns data pipelines, freshness, schema, and upstream data quality alerts.
   • ML Engineer: owns serving infra, latency, resource-related alerts.
   • Product Manager: owns business KPIs tied to model impact and prioritization for fixes.
   • Observability/Monitoring SRE: owns alert platform, dashboard templates, and PagerDuty/Jira integration.

3. Dashboards & reporting

   • Per-model dashboard: real-time and rolling-window performance, feature drift, cohort breakdowns, input completeness, and latency.
   • Team summary dashboard: consolidated health across models, risk score, and trending regressions.
   • Weekly report emailed to stakeholders with top anomalies and action items.

4. Alerting strategy

   • Multi-tier alerts:
     • P0 (Critical): Severe production degradation (e.g., accuracy drop > X% absolute or service outage). Triggers PagerDuty page to on-call SRE/ML engineer and notifies Model Owner.
     • P1 (High): Significant degradation or data pipeline failure. Creates Jira incident, emails Model Owner and Data Engineer, and notifies Slack channel.
     • P2 (Warning): Drift signals or slow trends (statistical tests exceed threshold). Creates Jira ticket in backlog and notifies Model Owner via Slack.
   • Use anomaly detection + statistical tests (KS, PSI, population stability) and rolling baselines; require multiple checks to reduce false positives (e.g., sustained change over 2 windows).

5. SLA targets

   • P0: acknowledge < 15 minutes, triage started < 30 minutes, mitigation or rollback decision within 2 hours.
   • P1: acknowledge < 1 hour, triage within 4 hours, remediation plan within 24 hours.
   • P2: acknowledge < 24 hours, investigation within 3 business days, fix scheduled within next sprint or deprioritized with PM sign-off.

6. Incident flow & integrations

   • Alerts integrate with PagerDuty for P0-P1 escalations; PagerDuty runbooks link to model dashboard, playbooks, and rollback procedures.
   • Alerts create templated Jira issues with metric snapshots, relevant logs, cohort examples, and assigned owner(s).
   • Slack channel auto-posts alert summary with links; escalation policy in PagerDuty notifies engineering on-call rotation if Model Owner unavailable.
   • Post-incident, link Jira to retrospective doc and update metric registry thresholds or monitoring logic if needed.

7. Feedback loops with engineering & product

   • Triage meeting within SLA includes Model Owner, Data Engineer, ML Engineer, and PM to decide mitigation (retrain, feature fix, rollback, or data fix).
   • Postmortem within 48 hours for P0/P1 incidents: root cause, corrective actions, timeline, and action owners. Update tests, data contracts, and dashboards.
   • Quarterly review with Product to align model metrics to business KPIs and adjust thresholds/SLOs.

8. Preventive measures & best practices

   • Canary & shadow deployments with canary metrics before full rollout.
   • Automated pre-deployment tests (data schema, small-scale performance) gated in CI.
   • Synthetic test data for end-to-end validation.
   • Versioned model registry linking to metric baselines for easier rollbacks.
